The Real Problem Isn’t Your Data — It’s Your Model Assumptions

Most organisations doing asset condition assessment have the same blind spot, and it’s not what they think it is. They assume they don’t have enough data. They assume their sensors aren’t accurate enough. They assume ML is for companies with bigger budgets and more sophisticated teams.

The actual problem is sitting quietly in their maintenance strategy document: a degradation model they’ve never validated against real data.

Organisations routinely assume a formula for how their assets degrade — a curve, a rule, a threshold — and build entire maintenance programmes on top of it. Nobody checks whether that formula reflects what the assets actually do in the field. Machine learning asset condition assessment changes that. It learns degradation behaviour from evidence rather than assuming it — and that distinction has serious consequences for cost, risk, and decision-making.

This article walks through the core ML techniques used in condition assessment, when each one is useful, and how to get started without needing a mountain of data or a data science team of twenty people.

Supervised Learning: Classification for Fault Detection

Supervised learning is the most accessible entry point into ML for condition assessment. You train a model on labelled historical data — records where you already know the outcome (failed or didn’t fail, fault type A or fault type B) — and the model learns to recognise the patterns that precede those outcomes.

This works well for fault detection where you have a reasonable history of failure events and their associated sensor signatures. Vibration profiles before a bearing failure, temperature gradients before a transformer fault, current draw anomalies before a motor trips — supervised models learn to spot these patterns earlier than traditional threshold-based rules.

When to use it: You have labelled failure data (even a modest amount), you’re trying to classify assets into condition states, and you want interpretable outputs that maintenance teams can act on.

What it needs: Consistent data labelling is the critical requirement. If your failure records are inconsistent — different teams recording the same fault type differently — the model will learn the noise rather than the signal.

Unsupervised Learning: Anomaly Detection for Unknown Failures

Here’s the honest limitation of supervised learning: it only catches what you’ve seen before. If your training data includes bearing failures, the model will find bearing failures. It won’t find the new failure mode your assets have developed since that data was collected.

Unsupervised anomaly detection doesn’t need labelled data. Instead, it learns what “normal” looks like and flags deviations. It’s particularly valuable for complex systems where failure modes aren’t fully catalogued, or where assets operate under variable conditions that make static thresholds unreliable.

This approach catches the failures you didn’t know to look for — which, in practice, are often the ones that cause the most disruption precisely because nobody had them on the radar.

The trade-off is more false positives and outputs that require more interpretation. Anomaly detection tells you something is unusual; it doesn’t always tell you what that unusual thing means. Pair it with domain expertise and you have a genuinely powerful early warning system.

Time Series Forecasting: Remaining Useful Life Prediction

Predicting remaining useful life (RUL) is the ambition behind most condition monitoring programmes. If you know how long an asset has left before it needs intervention, you can plan maintenance at the optimal point — not too early, not too late.

Time series models treat asset condition data as a sequence and learn how that sequence evolves over time. The model identifies trends, seasonal patterns, and the inflection points that signal accelerating degradation.

But here’s where most implementations fall short: they produce a point estimate — “this asset will fail in 90 days” — without any indication of how confident the model is in that prediction. That single number creates false precision.

Uncertainty quantification matters enormously here. A good RUL model doesn’t just tell you when an asset might fail; it tells you the range of likely outcomes and the confidence behind them. When you give clients that uncertainty band, something interesting happens: risk appetite becomes a real decision lever. A client who understands “there’s a 20% chance this fails within 60 days and an 80% chance it lasts 120 days” can make a conscious trade-off between maintenance cost and operational risk. That’s a fundamentally different conversation from “the model says 90 days.”

Deep Learning: Image-Based Inspection Analysis

Visual condition assessment — inspecting assets for cracking, corrosion, wear, deformation — has traditionally required trained inspectors physically present at the asset. That’s expensive, slow, and introduces variability between inspectors.

Deep learning models, particularly convolutional neural networks, can analyse images with a consistency and speed that human inspection can’t match at scale. Train them on labelled images of known condition states and they’ll classify new images reliably.

This is genuinely useful in contexts where inspection volumes are high and physical access is difficult or hazardous — rail infrastructure, bridge decks, high-voltage equipment. Drone-captured imagery combined with image classification models can turn a multi-week inspection programme into a matter of days.

The barrier to entry has dropped significantly. Pre-trained models are widely available, and transfer learning means you don’t need hundreds of thousands of labelled images to get started. A few hundred well-labelled examples of your specific asset type and failure modes can produce a useful working model.

Practical Considerations: Data Requirements and Model Validation

Let’s address the myth directly: you don’t need heaps of data to get started with ML for condition assessment.

You need relevant data. Quantity matters less than representativeness. A modest dataset that covers the range of operating conditions and asset states your model will encounter in deployment is worth more than a large dataset that only captures normal operation.

What does undermine ML work is data quality — missing timestamps, inconsistent labelling, sensors that drift over time, maintenance records that don’t capture actual failure events. Before worrying about whether you have enough data, audit what you have for consistency and completeness.

Model validation is non-negotiable. Test your model on data it hasn’t seen during training. Better still, run it in parallel with your existing rules for a period before you rely on it for decisions. ML models can overfit — they can learn patterns in your historical data that don’t generalise to new observations. Validation is how you find that out before it costs you.

When ML Adds Value vs When Simple Rules Suffice

Be honest about this: ML isn’t always the right tool. For assets with well-understood failure modes, clear threshold behaviours, and stable operating conditions, a simple rule — “replace when vibration exceeds X” — will outperform a complex model every time. Rules are transparent, auditable, and cheap to maintain.

ML adds genuine value when the relationship between condition indicators and failure is non-linear or context-dependent, when failure modes are multiple and variable, when you’re operating in degraded or changing environments, or when you’re specifically trying to learn what your assumed model gets wrong.

If your current thresholds are working and your maintenance costs are under control, the right call might be to validate your existing model rather than replace it. ML is a means, not an end.

Tools and Frameworks: A Vendor-Neutral Overview

The ML ecosystem is mature and largely open-source. Python is the dominant language, and the core libraries — scikit-learn for classical ML, TensorFlow and PyTorch for deep learning, Prophet and statsforecast for time series — are well-documented and widely supported.

For uncertainty quantification, libraries like MAPIE and uncertainty-toolbox make it practical to produce confidence intervals alongside point predictions without needing a research background.

Cloud platforms (AWS SageMaker, Azure Machine Learning, Google Vertex AI) provide managed infrastructure if you want to scale without managing servers. For smaller programmes, a well-configured laptop and a clean Python environment will take you further than most people expect.

The tooling isn’t the constraint. Framing the right problem is.

Getting Started: Pilot Project Selection

Pick your first ML project carefully. The goal isn’t to prove ML works in general — it’s to demonstrate value on a specific, bounded problem that your organisation cares about.

Look for: an asset class with a history of costly or disruptive failures, reasonable sensor coverage, and a maintenance team willing to engage with the outputs. Avoid starting with your most critical assets (the stakes are too high for a first run) or your least-instrumented ones (not enough signal to work with).

Start with anomaly detection or a simple classifier. These are easier to validate, easier to explain to maintenance teams, and faster to produce a working result. Build confidence before you tackle remaining useful life prediction.

The most important question to answer in a pilot isn’t “does the model perform well?” It’s “does this model produce outputs our people will actually use?” A technically excellent model that nobody trusts is worthless. Build the technical credibility and the organisational trust together.
